Tokenmaxxing BERT: 50x faster tokenization
Blog post from Hugging Face
Hugging Face’s ongoing revival of its tokenizers library has improved BERT’s WordPiece tokenization by up to 50 times relative to version 0.23 through optimizations to its previously dominant text-normalization stage. Profiling showed that normalization consumed 88% of encoding time, largely because every character, including ordinary ASCII letters, underwent expensive Unicode processing and binary searches to identify accent marks. The revised implementation skips long ASCII runs using SIMD instructions, applies whitespace cleanup and lowercasing in bulk, caches normalization behavior for 256-code-point Unicode pages, and avoids allocations or copying when input is already normalized. Benchmarks report that the normalizer’s share of runtime fell to about 13%, with the largest end-to-end gains for English and source code, while Russian, Greek, and Arabic also benefited from Unicode-page caching despite containing less ASCII. The changes preserve identical token IDs across tested corpora and also accelerate NFC normalization used by models such as ModernBERT, although small inputs and CJK-heavy text may see limited gains or modest slowdowns because they benefit less from ASCII skipping and, in BERT’s case, require additional handling of Chinese characters.
