Apache Spark Profiling: What to Measure and How to Interpret the Results
Blog post from Acceldata
Apache Spark profiling helps diagnose jobs that complete successfully but run slower than expected by correlating code-level, stage-level, and cluster-level metrics. Investigation should begin in the Spark UI’s SQL tab to identify costly operators, trace their stages and shuffle boundaries, compare stage durations, and examine task-duration differences for skew. Important indicators include shuffle spill, garbage collection time, shuffle volume, and uneven task runtimes, while Python UDF profiling can identify expensive functions, frequent calls, memory allocations, and opportunities to use native Spark operations. Because Spark UI data alone may not reveal Kubernetes-related causes, teams should also inspect executor OOM kills, node resource contention, and pod scheduling delays through infrastructure telemetry. Effective tuning links each abnormal signal to a likely cause, changes one configuration or code variable at a time, and compares subsequent runs, while ongoing monitoring and retained event logs help identify regressions as workloads, data volumes, and infrastructure evolve.
